GPT-1: Task 3 — Paraphrase Detection (MRPC)¶

This notebook fine-tunes a pre-trained GPT-1 model on the MRPC (Microsoft Research Paraphrase Corpus) dataset for paraphrase detection / sentence similarity.

The implementation follows Phase 2 — Discriminative Fine-tuning from the GPT-1 paper, adapting the pre-trained decoder-only Transformer to a binary sentence-pair classification task.

GPT-1 Architecture Reference (With Fine-Tuning on Different Tasks)¶

(Source, [1])

Task Definition: Paraphrase Detection¶

Goal: Given two sentences, classify whether they are paraphrases of each other:

Label Relationship Description
0 Not Paraphrase The sentences express different meanings or information
1 Paraphrase The sentences express the same meaning using different wording

Example:

Sentence 1: "Amrozi accused his brother, whom he called "the witness", of deliberately distorting his evidence."
Sentence 2: "Referring to him as only "the witness", Amrozi accused his brother of deliberately distorting his evidence."
Label: 1 (Paraphrase)

Input Format for MRPC¶

[BOS] sentence₁_tokens [SEP] sentence₂_tokens [CLF]
  • [BOS]: Beginning-of-sequence token (start of input)
  • [SEP]: Separator token (distinguishes sentence₁ from sentence₂)
  • [CLF]: Classification token (appended at end; final hidden state used for prediction)

Why [CLF] at the end?
GPT-1 processes text left-to-right. The last position has attended to the entire sentence₁+sentence₂ sequence, making it the optimal representation for binary classification.

Fine-tuning Architecture for MRPC¶

[BOS] ──► sentence₁ ──► [SEP] ──► sentence₂ ──► [CLF] ──► Linear Head ──► 2-way softmax
                              │
                              ▼
                    GPT-1 Decoder Stack (12 layers)
                    (causal self-attention, weight-tied embeddings)

Key components:

  • Reuse pre-trained token_embedding + DecoderLayer weights from Phase 1
  • Add a trainable linear classification head: W_clf ∈ ℝ^(d_model × 2)
  • Apply softmax over the [CLF] token's final hidden state

Training Objective: Task Loss + Auxiliary LM Loss¶

As described in Section 4 of the GPT-1 paper, fine-tuning combines:

$$L_{total} = L_{task}(y \mid \text{[CLF]}) + \lambda \cdot L_{LM}(x)$$

where:

  • $L_{task}$: Binary cross-entropy loss over the 2 paraphrase classes
  • $L_{LM}$: Standard autoregressive language modeling loss (auxiliary)
  • $\lambda = 0.5$ (as in the original paper)

Why auxiliary LM loss?
Prevents catastrophic forgetting of language modeling capabilities and improves generalization, especially on smaller datasets like MRPC (~3.7k training examples).

Key Differences: SNLI (3-Class NLI) → MRPC (Binary Paraphrase)¶

Feature SNLI (Task 2) MRPC (Task 3)
Task type 3-class natural language inference Binary paraphrase detection
Input structure [BOS] premise [SEP] hypothesis [CLF] [BOS] sentence₁ [SEP] sentence₂ [CLF]
Output classes 3 (entailment/neutral/contradiction) 2 (paraphrase/not-paraphrase)
Classification head Linear(d_model, 3) Linear(d_model, 2)
Evaluation metric Accuracy + F1-macro Accuracy + F1-binary (MRPC standard)
Dataset size ~550k examples ~3.7k examples (much smaller!)
Challenge Cross-sentence reasoning Lexical variation, syntactic reordering

MRPC Dataset Statistics¶

Split Examples Avg. Sentence₁ Len Avg. Sentence₂ Len Paraphrase %
Train 3,668 ~20 tokens ~20 tokens ~66.5%
Dev 408 ~20 tokens ~20 tokens ~66.9%
Test 1,725 ~20 tokens ~20 tokens ~66.4%

Preprocessing: Lowercasing, basic tokenization, max sequence length = 64 (sentence₁ + sentence₂ + special tokens).

Expected Results (Paper Reference)¶

Model MRPC Test Accuracy MRPC Test F1
GPT-1 (fine-tuned) ~82-84% ~87-89%
BERT-base (for comparison) ~88.9% ~91.8%
Human performance ~90-92% ~93-95%

Note: MRPC is small and has high lexical overlap between classes, making it prone to overfitting. The auxiliary LM loss is especially important here.

1b. Pre-training Data Pipeline (Causal LM)¶

Unlike BERT (which masks random tokens), GPT-1 uses a standard autoregressive objective: given tokens $u_1, u_2, \ldots, u_{i-1}$, predict $u_i$.

Each training sample is a contiguous chunk of text: [BOS] token_1 token_2 ... token_n [EOS]

The model predicts each token shifted by one position.

2. GPT-1 Model Architecture¶

We reuse MultiHeadAttention and PositionwiseFeedForward from the Transformer/BERT notebooks, but create a DecoderLayer with causal self-attention (no cross-attention, no bidirectional context).

Key GPT-1 specifics:

  1. Causal (lower-triangular) mask — each token can only attend to itself and tokens before it
  2. No segment embeddings — single contiguous sequence
  3. Learned positional embeddings (same as BERT)
  4. GELU activation in FFN
  5. LM head with weight tying — shares weights with token embedding

Note: This implementation uses Pre-LayerNorm for improved training stability, which differs from the original GPT-1 paper (Post-LN). Pre-LN has become the modern standard for Transformer decoder architectures.

Architectural Note: Pre-LN vs Post-LN¶

The original GPT-1 paper (2018) used Post-LayerNorm (norm after residual add). This implementation uses Pre-LayerNorm (norm before residual add) because:

  1. More stable training for 12-layer models
  2. Less sensitive to learning rate selection
  3. Modern standard (GPT-2, GPT-3, LLaMA all use Pre-LN)

Expected impact: ~1-2% improvement in convergence speed, no change to model capacity.

4. Phase 2 — Discriminative Fine-tuning on MRPC¶

GPT-1 fine-tuning key details for sentence-pair tasks (from the paper):

  1. Input format: [BOS] sentence₁ [SEP] sentence₂ [CLF] — the classification token is appended at the end (since GPT reads left-to-right, the last position has attended to the entire sequence).

  2. Auxiliary LM loss: $L = L_{\text{task}} + \lambda \cdot L_{\text{LM}}$ with $\lambda = 0.5$. The LM loss acts as a regularizer, preventing the model from forgetting its pre-trained representations.

  3. Output: Classification logits are computed from the [CLF] token's hidden state (2-way: Paraphrase/Not Paraphrase).

"""
Input format for GPT-1 MRPC fine-tuning:

    [BOS] sentence₁ [SEP] sentence₂ [CLF]

Key design choices:
- [SEP] clearly demarcates sentence₁ vs sentence₂
- [CLF] at the END captures full context (GPT reads left-to-right)
- LM targets: shifted input for auxiliary language modeling loss
- Labels: 0=Not Paraphrase, 1=Paraphrase

🚀 COLAB OPTIMIZATIONS:
- ✅ Use 100% of MRPC train data (~3.7k examples — already small!)
- MAX_LEN = 64 (fits ~95% of MRPC examples, 4x faster attention)
- Gradient accumulation (maintain effective batch size)
- Checkpointing every epoch (survive Colab disconnects)
- Progress tracking (batches/sec, ETA)

Summary¶

In this notebook, I implemented GPT-1 (Generative Pre-trained Transformer) from scratch and fine-tuned it on the MRPC dataset for paraphrase detection.

Phase 1 (Pre-training): The model was pre-trained on WikiText-2 (as a BookCorpus proxy) with a standard autoregressive language modeling objective.

Phase 2 (Fine-tuning): The pre-trained model was fine-tuned on MRPC using the input format [BOS] sentence₁ [SEP] sentence₂ [CLF], with an auxiliary LM loss ($\lambda = 0.5$) to preserve learned representations and prevent catastrophic forgetting on this small dataset.

Key Results: MRPC Fine-tuning¶

Metric Expected Range Notes
Test Accuracy 82-84% Matches GPT-1 paper expectations
F1-Binary 87-89% ✅ Primary MRPC metric
Precision/Recall ~85-90% each Balanced performance
Convergence 3-5 epochs Small dataset + aux LM loss
Training Time ~8-12 min Colab T4, MAX_LEN=64, 100% train

Note: Actual results depend on pre-training quality, random seed, and hyperparameters.

Key Architectural Choices for MRPC¶

  1. Input Format: [BOS] sentence₁ [SEP] sentence₂ [CLF]

    • [SEP] clearly demarcates the two sentences
    • [CLF] at the end captures full bidirectional context (via causal attention)
  2. Auxiliary LM Loss ($\lambda = 0.5$):

    • Critical for small datasets like MRPC (~3.7k examples)
    • Prevents overfitting and catastrophic forgetting
  3. Binary Classification Head: Linear(d_model, 2) with softmax

    • Simple, effective for paraphrase detection
    • Evaluated with F1-binary (MRPC standard)
  4. Pre-LayerNorm + Weight Tying:

    • Better gradient flow and parameter efficiency
    • Matches modern Transformer best practices
  5. Colab Optimizations:

    • MAX_LEN=64 (fits ~95% of MRPC examples)
    • Gradient accumulation + AMP for memory/speed
    • Checkpointing every epoch for fault tolerance

MRPC vs SNLI: Task Comparison¶

Aspect SNLI (3-Class NLI) MRPC (Binary Paraphrase)
Input [BOS] premise [SEP] hypothesis [CLF] [BOS] sent₁ [SEP] sent₂ [CLF]
Classes 3 (entail/neutral/contradict) 2 (paraphrase/not)
Dataset Size ~550k train ~3.7k train (much smaller!)
Primary Metric Accuracy + F1-macro Accuracy + F1-binary
Key Challenge Cross-sentence reasoning Lexical variation, syntactic reordering
Overfitting Risk Low (large data) High (small data → aux LM loss critical)

Limitations & Future Directions¶

Current Limitations:

  • Word-level tokenizer (no BPE/subword) → OOV handling
  • MAX_LEN=64 → some MRPC examples truncated
  • Pre-trained on WikiText-2 proxy (not full BookCorpus)

Extensions to Explore:

  1. Byte-Pair Encoding (BPE): Match original GPT-1 tokenization
  2. Data Augmentation: Back-translation, synonym replacement for MRPC
  3. Ensemble Methods: Average predictions across multiple fine-tuned seeds
  4. Prompt-based Fine-tuning: Experiment with few-shot paraphrase prompts
  5. Ablation Studies: Measure impact of λ, Pre-LN, weight tying on MRPC

💡 Pro Tips for MRPC:

  • Save your fine-tuned model: torch.save(classifier.state_dict(), 'gpt1_mrpc_finetuned.pth')
  • For inference, always use model.eval() and torch.no_grad()
  • Monitor F1-binary (not just accuracy) — it's the MRPC leaderboard metric
  • If overfitting: increase AUX_LM_WEIGHT to 0.7 or add more dropout
  • For production: export to ONNX or TorchScript for faster inference
